Abstract
Description
Atty Dkt No: 114096-5299 PCTSYSTEMS AND METHODS FOR NEW INTERNAL DONOR DISCOVERY CROSS-REFERENCE TO RELATED APPLICATIONS
[0001] This application claims the benefit of and priority to U.S. Non-Provisional Application No. 19 / 182,507, filed April 17, 2025, the contents of which are incorporated herein by reference in their entirety for any and all purposesBACKGROUND
[0002] Ziegler-Natta (Z / N) type catalysts are used in the production of olefin polymers. Generally, Ziegler-Natta catalysts for polypropylene may include a magnesium compound-supported titanium compound, and an organic molecule known as an internal donor. This procatalyst is combined with aluminum compound co-catalyst, and optionally an external electron donor in the presence of alpha olefin in the polymerization reactor to afford polypropylene.SUMMARY
[0003] Ziegler-Natta catalyst compositions can optionally be made using one or more internal electron donors. The internal electron donors are bound to the procatalyst and added during the catalyst synthesis process. The internal electron donors can determine to a large extent the performance properties of the overall catalyst composition, such as the catalyst activity and catalyst lifetime. The internal electron donors can also influence the properties of polymers made from the catalyst composition. For instance, internal electron donors can influence polymer melt flow rates, xylene soluble content, molecular weight distribution and the like.
[0004] Conventional phthalate internal donors have certain disadvantages, which may include heightened regulatory scrutiny, restricted uses, and issues with catalyst performance that lead to undesirable polymer properties (e.g., xylene solubility, melt flow index, and molecular weight distribution).
[0005] At least one aspect of the present disclosure is directed to a system. The system may include one or more processors coupled to non-transitory memory. The one or more processors may be configured to identify a data structure comprising one or more chemical structures as candidate internal donors for polyolefin procatalysts, the one or more chemical-1- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTstructures represented as a data string defined according to a predetermined specification. [0029] Various embodiments are described hereinafter. It should be noted that the specific embodiments are not intended as an exhaustive description or as a limitation to the broader aspects discussed herein. One aspect described in conjunction with a particular embodiment is not necessarily limited to that embodiment and can be practiced with any other embodiment(s).
[0030] New nonphthalate internal donors are useful for meeting regulatory standards and achieving catalyst performance targets for polymer properties. However, developing new internal donors can be a costly and time-consuming process.
[0031] Disclosed herein are systems and methods for identifying candidate internal donors for polyolefin procatalysts using one or more machine-learning models to predict internal donor parameters, including catalyst performance and resulting polymer properties. The procatalyst may include a magnesium compound-supported titanium compound, and an organic molecule known as an internal donor. This procatalyst is combined with aluminum compound co-catalyst, and optionally an external electron donor in the presence of alpha olefin in the polymerization reactor to afford polypropylene.-7- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCT
[0032] Conventional approaches for predicting internal donor performance typically provide inconsistent or inaccurate results. This can be due to the fact that larger data sets (e.g., including hundreds of internal donor parameters) are challenging to efficiently and accurately process using conventional approaches. To address these challenges, the systems and methods of this technical solution implement approaches for training and using one or more machine-learning models to predict internal donor performance given a subset of information. The technical solution can involve the use of datasets that omit data that may negatively skew machine-learning predictions. Therefore, the systems and methods disclosed herein may be trained with using datasets including a smaller subset of internal donor parameters (e.g., 1-100, 1-50, 1-20, 1-10, 2-10, or 2-6 parameters). The use of smaller datasets both improves the accuracy of the output data and improves computational performance by reducing the amount of information that is to be processed to generate predictions.
[0033] Referring to FIG. 1, illustrated is a block diagram of an example system 100 for predicting polyolefin procatalyst internal donor percentage using a machine learning model updated using a plurality of training examples, each training example including chemical structure and respective internal donor percentage. [0262] At act 810, the system provides the data structure as input to a machine learning model to generate a predicted internal donor percentage for each resulting polyolefin procatalyst created using each chemical structure in the data structure. The machine learning model may be trained using training examples as disclosed herein.
[0263] At act 815, the system provides for presentation an output including the predicted internal donor percentage for each of the one or more chemical structures. The output may include one or more additional parameters. These additional parameters may include one or more polymerization parameters, one or more polyolefin properties, or a combination thereof, as disclosed herein.
[0264] FIG. 9 is a component diagram of an example computing system suitable for use in the various implementations described herein, according to an example implementation. For example, the computing system 900 may implement any of the systems disclosed herein, or various other example systems and devices described in the present disclosure.
[0265] The computing system 900 includes a bus 902 or other communication component for communicating information and a processor 904 coupled to the bus 902 for processing information. The computing system 900 also includes main memory 906, such as a RAM or other dynamic storage device, coupled to the bus 902 for storing information, and instructions to be executed by the processor 904. Main memory 906 can also be used for storing position information, temporary variables, or other intermediate information during execution of instructions by the processor 904. The computing system 900 may further include a ROM 908 or other static storage device coupled to the bus 902 for storing static information and instructions for the processor 904. A storage device 910, such as a solid-state device, magnetic disk, or optical disk, is coupled to the bus 902 for persistently storing information and instructions.
[0266] The computing system 900 may be coupled via the bus 902 to a display 914, such as a liquid crystal display, or active matrix display, for displaying information and notifications to a user. An input device 912, such as a keyboard including alphanumeric and other keys, may be coupled to the bus 902 for communicating information, and command selections to -70- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTthe processor 904. In another implementation, the input device 912 has a touch screen display. The input device 912 can include any type of biometric sensor, or a cursor control, such as a mouse, a trackball, or cursor direction keys, for communicating direction information and command selections to the processor 904 and for controlling cursor movement on the display 914.
[0267] In some implementations, the computing system 900 may include a communications adapter 916, such as a networking adapter. Communications adapter 916 may be coupled to bus 902 and may be configured to enable communications with a computing or communications network or other computing systems. In various illustrative implementations, any type of networking configuration may be achieved using communications adapter 916, such as wired (e.g., via Ethernet), wireless (e.g., via Wi-Fi, Bluetooth), satellite (e.g., via GPS) pre-configured, ad-hoc, LAN, WAN, and the like.
[0268] According to various implementations, the processes of the illustrative implementations that are described herein can be achieved by the computing system 900 in response to the processor 904 executing an implementation of instructions contained in main memory 906. Such instructions can be read into main memory 906 from another computer-readable medium, such as the storage device 910. Execution of the implementation of instructions contained in main memory 906 causes the computing system 900 to perform the illustrative processes described herein. One or more processors in a multi-processing implementation may also be employed to execute the instructions contained in main memory 906. In alternative implementations, hard-wired circuitry may be used in place of or in combination with software instructions to implement illustrative implementations. Thus, implementations are not limited to any specific combination of hardware circuitry and software.
[0269] The present technology, thus generally described, will be understood more readily by reference to the following examples, which are provided by way of illustration and are not intended to be limiting of the present technology.EXAMPLES
[0270] Prior attempts at predicting internal donor percentage using a trained machine learning model using data including many different parameters was unsuccessful. It was suspected that certain subsets of data could be negatively skewing data outputs. Therefore, a -71- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTsmaller subset of data with fewer inputs was chosen to prioritize fewer parameters. The system of FIG. 1 was used to train the machine learning model and predict internal donor percentage.
[0271] Donor incorporation percentage was chosen as the priority of interest, since there may be a high correlation with a candidate donor’s ability to coordinate and the chance for a successful procatalyst.
[0272] The machine learning model was trained using training examples including SMILES chemical structures and corresponding internal donor percentage. A set of 5 data structures including 39 chemical structures were excluded from the training examples to use as a validation set.
[0273] The model was analyzed and feature importance was reviewed. Model outputs for internal donor percentage were consistent with known chemistry principles. FIG. 10 is a graph of actual vs. predicted internal donor percentage for respective candidate internal donors generated using the system of FIG. 1, indicating good alignment.
[0274] Further refinement was performed on the model so that large queries of molecules could be tested against the model with one input: FIG. 11 is a graph of internal donor percentage (“% donor”) vs. catalyst activity (kg / g) for candidate internal donors generated using the system of FIG. 1, indicating a positive correlation.
[0275] Model validation was further performed by using 5 excluded data structures as input to the model. FIG. 12 is a graph of internal donor percentage vs. octanol / water partition coefficient (“XLogP”) for candidate internal donors generated using the system of FIG. 1.
[0276] In another example, training examples input to the model for training included internal donor percentage and additional parameters. These additional parameters included XS and catalytic activity, in accordance with the system in FIG. 2. Data structures were input to the model trained with these additional parameters to predict XS, catalytic activity, and internal donor percentage. FIGS. 13A-13C are graphs of actual vs. predicted parameters for respective candidate internal donors generated using the system of FIG. 2. FIG. 13 A is a graph of actual vs. predicted xylene solubility (XS). FIG. 13B is a graph of actual vs. predicted catalytic activity. FIG. 13C is a graph of actual vs. predicted internal donor percentage.-72- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCT
[0277] In another example, training examples input to the model for training included internal donor percentage and physical properties, including DFT calculations, in accordance with the system in FIG. 3. FIGS. 14A-14E are graphs of predicted vs. actual parameters for respective candidate internal donors generated using the system of FIG. 3. FIG. 14A is a graph of actual vs. predicted catalytic activity. FIG. 14B is a graph of actual vs. predicted xylene solubility. FIG. 14C is a graph of actual vs. predicted internal donor percentage.
[0278] While certain embodiments have been illustrated and described, it should be understood that changes and modifications can be made therein in accordance with ordinary skill in the art without departing from the technology in its broader aspects as defined in the following claims.
[0279] The present disclosure is not to be limited in terms of the particular embodiments described in this application. Many modifications and variations can be made without departing from its spirit and scope, as will be apparent to those skilled in the art.Functionally equivalent methods and compositions within the scope of the disclosure, in addition to those enumerated herein, will be apparent to those skilled in the art from the foregoing descriptions. Such modifications and variations are intended to fall within the scope of the appended claims. The present disclosure is to be limited only by the terms of the appended claims, along with the full scope of equivalents to which such claims are entitled. It is to be understood that this disclosure is not limited to particular methods, reagents, compounds, compositions, or biological systems, which can of course vary. It is also to be understood that the terminology used herein is for the purpose of describing particular embodiments only, and is not intended to be limiting.
[0280] The implementations described herein have been described with reference to drawings. The drawings illustrate certain details of specific implementations that implement the systems, methods, and programs described herein. However, describing the implementations with drawings should not be construed as imposing on the disclosure any limitations that may be present in the drawings.
[0281] It should be understood that no claim element herein is to be construed under the provisions of 35 U.S.C. § 112(f), unless the element is expressly recited using the phrase “means for.”-73- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCT
[0282] As understood by one of ordinary skill in the art, “internal donor percentage”, “internal donor percentage in the procatalyst composition”, and “internal donor incorporation in polyolefin procatalyst percentage” refer to the relative amount of the internal donor incorporated into the Ziegler-Natta type procatalyst. The internal donor percentage may be the percent of donor remaining in procatalyst composition after preparation of the procatalyst. The internal donor percentage may be defined as the weight percentage of the internal donor relative to the weight of all other catalyst components in the procatalyst composition.“Internal electron donor”, “internal donor,” and “donor” may have the same meaning and may be used interchangeably.
[0283] As understood by one of ordinary skill in the art, “xylene soluble” (also referred to as “XS”) may be defined as the weight percent of resin that remains in solution after a sample of polypropylene random copolymer resin is dissolved in hot xylene and the solution is allowed to cool to 25° C. This is also referred to as the gravimetric XS method according to ASTM D5492-98 using a 90 minute precipitation time and is a referred to herein as the “wet method.” Xylene solubles is measured on the reactor powder without the addition of any other additives.
[0284] The xylene soluble portion is determined by a method adapted from ASTM D5492-06 and also sometimes referred to herein as the “wet method”. The procedure consists of weighing 2 g of sample and dissolving the sample in 200 mL o-xylene in a 400 ml flask with 24 / 40 joint. The flask is connected to a water cooled condenser and the contents are stirred and heated to reflux under nitrogen (N2), and then maintained at reflux for an additional 30 minutes. The solution is then cooled in a temperature controlled water bath at 25 °C for 90 minutes to allow the crystallization of the xylene insoluble fraction. Once the solution is cooled and the insoluble fraction precipitates from the solution, the separation of the xylene soluble portion (XS) from the xylene insoluble portion (XI) is achieved by filtering through 25 micron filter paper. One hundred mL of the filtrate is collected into a pre-weighed aluminum pan, and the o-xylene is evaporated from this 100 mL of filtrate under a nitrogen stream. Once the solvent evaporated from this 100 mL of filtrate under a nitrogen stream. Once the solvent is evaporated, the pan and contents are placed in a 100 °C vacuum oven for 30 minutes or until dry. The pan is then allowed to cool to room temperature and weighed. The xylene soluble portion is calculated as XS (wt. %)=[(m3-m2)x2 / mL] x 100, where mL-74- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTis the original weight of the sample used, m2 is the weight of empty aluminum pan, and m3 is the weight of the pan and residue.
[0285] As understood by one of ordinary skill in the art, “H2 charge” and “H2 charge value” refer to the amount of hydrogen gas added during the polymerization process of the polyolefin to control the molecular weight of the resulting polyolefin by acting as a chain transfer agent. The H2 charge value may influence the length of the polyolefin chain to provide precise control of one or more polymer properties.
[0286] As understood by one of ordinary skill in the art, “catalytic activity” and catalytic activity value” refer to the ability of the catalyst to accelerate the polyolefin polymerization reaction. The catalytic activity may be expressed as, for example, kg of polymer produced per g of catalyst, or catalytic efficiency (CE) in units of kg of polymer per gram of catalyst during the polymerization for 1 hour.
[0287] As understood by one of ordinary skill in the art, “catalyst lifetime” and “catalyst lifetime value” refer to the period during which the catalyst remains effective in facilitating the polymerization reaction before it loses its activity or requires replacement or regeneration. A longer catalyst lifetime may be desirable in industrial processes, as it reduces the frequency of catalyst replacement, lowers costs, and ensures consistent product quality.
[0288] As understood by one of ordinary skill in the art, “poly dispersity index” (also referred to as PDI) is a measure of the distribution of molecular weight in a given polyolefin sample, and may be calculated as the ratio of the weight average molecular weight to the number average molecular weight.
[0289] As understood by one of ordinary skill in the art, “melt flow rate” (also referred to as MFR, melt flow index, and MFI) is a measure of the flowability of the polyolefin melt under a temperature and a load condition. MFR may be used to assess the viscosity and processability of polyolefins. The MFR is measured according to ASTM standard D1238 T. The value of MFR may be given in units of grams per 10 minutes (g / 10 min), which represents the mass of polymer extruded through a standard die over a 10-minute period under specified conditions.

Alternatively or additionally, the one or more processors may be structured to perform or otherwise execute certain operations independent of one or more co-processors.
[0292] In other example implementations, two or more processors may be coupled via a bus to enable independent, parallel, pipelined, or multi -threaded instruction execution. Each processor may be implemented as one or more general -purpose processors, ASICs, FPGAs, GPUs, TPUs, digital signal processors (DSPs), or other suitable electronic data processing components structured to execute instructions provided by memory. The one or more processors may take the form of a single core processor, multi-core processor (e.g., a dual core processor, triple core processor, or quad core processor), microprocessor, etc. In some implementations, the one or more processors may be external to the apparatus, for example, the one or more processors may be a remote processor (e.g., a cloud-based processor).Alternatively or additionally, the one or more processors may be internal or local to the-76- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTapparatus. In this regard, a given circuit or components thereof may be disposed locally (e.g., as part of a local server, a local computing system) or remotely (e.g., as part of a remote server such as a cloud based server). Comparatively, the term “output device,” as described herein, may include any type of output device including, but not limited to, a computer monitor, printer, facsimile machine, or other output devices performing a similar function.
[0295] As used herein and in the appended claims, singular articles such as “a” and “an” and “the” and similar referents in the context of describing the elements (especially in the context of the following claims) are to be construed to cover both the singular and the plural, unless otherwise indicated herein or clearly contradicted by context. Recitation of ranges of-77- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTvalues herein are merely intended to serve as a shorthand method of referring individually to each separate value falling within the range, unless otherwise indicated herein, and each separate value is incorporated into the specification as if it were individually recited herein. All methods described herein can be performed in any suitable order unless otherwise indicated herein or otherwise clearly contradicted by context. The use of any and all examples, or exemplary language (e.g., “such as”) provided herein, is intended merely to better illuminate the embodiments and does not pose a limitation on the scope of the claims unless otherwise stated. No language in the specification should be construed as indicating any non-claimed element as essential.
[0296] As used herein, “about” will be understood by persons of ordinary skill in the art and will vary to some extent depending upon the context in which it is used. If there are uses of the term which are not clear to persons of ordinary skill in the art, given the context in which it is used, “about” will mean up to plus or minus 10% of the particular term - for example, “about 10 wt.%” would be understood to mean “9 wt.% to 11 wt.%.” It is to be understood that when “about” precedes a term, the term is to be construed as disclosing “about” the term as well as the term without modification by “about” - for example, “about 10 wt.%” discloses “9 wt.% to 11 wt.%” as well as disclosing “10 wt.%.”
[0297] The phrase “and / or” as used in the present disclosure will be understood to mean any one of the recited members individually or a combination of any two or more thereof -for example, “A, B, and / or C” would mean “A or B or C; A and B; A and C; B and C; or the combination of A, B, and C.”
[0298] As will be understood by one skilled in the art, for any and all purposes, particularly in terms of providing a written description, all ranges disclosed herein also encompass any and all possible subranges and combinations of subranges thereof. Any listed range can be easily recognized as sufficiently describing and enabling the same range being broken down into at least equal halves, thirds, quarters, fifths, tenths, etc. As a non-limiting example, each range discussed herein can be readily broken down into a lower third, middle third and upper third, etc. As will also be understood by one skilled in the art all language such as “up to,” “at least,” “greater than,” “less than,” and the like include the number recited and refer to ranges which can be subsequently broken down into subranges as discussed above. Finally, as will be understood by one skilled in the art, a range includes each individual member. Thus, for example, a group having 1-3 atoms refers to groups having 1, 2, or 3 atoms.-78- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTSimilarly, a group having 1-5 atoms refers to groups having 1, 2, 3, 4, or 5 atoms, and so forth.
[0299] As understood by one of ordinary skill in the art, “molecular weight” (also known as “relative molar mass”) is a dimensionless quantity but is converted to molar mass by multiplying by 1 gram / mole or by multiplying by 1 Da - for example, a compound with a weight-average molecular weight of 5,000 has a weight-average molar mass of 5,000 g / mol and a weight-average molar mass of 5,000 Da.
[0300] It should be noted that although the diagrams herein may show a specific order and composition of method steps, it is understood that the order of these steps may differ from what is depicted. For example, two or more steps may be performed concurrently or with partial concurrence. Also, some method steps that are performed as discrete steps may be combined, steps being performed as a combined step may be separated into discrete steps, the sequence of certain processes may be reversed or otherwise varied, and the nature or number of discrete processes may be altered or varied. The order or sequence of any element or apparatus may be varied or substituted according to alternative implementations.Accordingly, all such modifications are intended to be included within the scope of the present disclosure as defined in the appended claims. Such variations will depend on the machine-readable media and hardware systems chosen and on designer choice. It is understood that all such variations are within the scope of the disclosure. Likewise, software and web implementations of the present disclosure could be accomplished with standard programming techniques with rule-based logic and other logic to accomplish the various database searching steps, correlation steps, comparison steps, and decision steps.
[0301] While this specification contains many specific implementation details, these should not be construed as limitations on the scope of any inventions or of what may be claimed, but rather as descriptions of features specific to particular implementations of the systems and methods described herein. Certain features that are described in this specification in the context of separate implementations can also be implemented in combination in a single implementation. Conversely, various features that are described in the context of a single implementation can also be implemented in multiple implementations separately or in any suitable subcombination. Moreover, although features may be described above as acting in certain combinations and even initially claimed as such, one or more features from a claimed-79- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCTcombination can in some cases be excised from the combination, and the claimed combination may be directed to a subcombination or variation of a subcombination.
[0302] In certain circumstances, multitasking and parallel processing may be advantageous. Moreover, the separation of various system components in the implementations described above should not be understood as requiring such separation in all implementations, and it should be understood that the described program components and systems can generally be integrated together in a single software product or packaged into multiple software products.
[0303] Having now described some illustrative implementations and implementations, it is apparent that the foregoing is illustrative and not limiting, having been presented by way of example. In particular, although many of the examples presented herein involve specific combinations of method acts or system elements, those acts and those elements may be combined in other ways to accomplish the same objectives. Acts, elements, and features discussed only in connection with one implementation are not intended to be excluded from a similar role in other implementations.
[0304] The phraseology and terminology used herein is for the purpose of description and should not be regarded as limiting. The use of “including,” “comprising,” “having,” “containing,” “involving,” “characterized by,” “characterized in that,” and variations thereof herein, is meant to encompass the items listed thereafter, equivalents thereof, and additional items, as well as alternate implementations consisting of the items listed thereafter exclusively. In one implementation, the systems and methods described herein consist of one, each combination of more than one, or all of the described elements, acts, or components.
[0305] Any references to implementations or elements or acts of the systems and methods herein referred to in the singular may also embrace implementations including a plurality of these elements, and any references in plural to any implementation or element or act herein may also embrace implementations including only a single element. References in the singular or plural form are not intended to limit the presently disclosed systems or methods, their components, acts, or elements to single or plural configurations. References to any act or element being based on any information, act, or element may include implementations where the act or element is based at least in part on any information, act, or element.-80- 4924-7946-3444.6Atty Dkt No: 114096-5299 PCT
[0306] Any implementation disclosed herein may be combined with any other implementation, and references to “an implementation,” “some implementations,” “an alternate implementation,” “various implementation,” “one implementation,” or the like are not necessarily mutually exclusive and are intended to indicate that a particular feature, structure, or characteristic described in connection with the implementation may be included in at least one implementation. Such terms as used herein are not necessarily all referring to the same implementation. Any implementation may be combined with any other implementation, inclusively or exclusively, in any manner consistent with the aspects and implementations disclosed herein.
[0307] References to “or” may be construed as inclusive so that any terms described using “or” may indicate any of a single, more than one, and all of the described terms.
[0308] Where technical features in the drawings, detailed description or any claim are followed by reference signs, the reference signs have been included for the sole purpose of increasing the intelligibility of the drawings, detailed description, and claims. Accordingly, neither the reference signs nor their absence have any limiting effect on the scope of any claim elements.
[0309] The foregoing description of implementations has been presented for purposes of illustration and description. It is not intended to be exhaustive or to limit the disclosure to the precise form disclosed, and modifications and variations are possible in light of the above teachings or may be acquired from this disclosure.
