METHODS OF TRAINING AN END-TO-END STRUCTURE OF A WIRELESS COMMUNICATION SYSTEMCROSS REFERENCE TO RELATED PATENT APPLICATION (S)

[0004] With the rapid development in recent years, deep learning has become one of the candidates for revolutionary techniques to improve performance of the physical layer (PHY) in wireless communication systems. Traditional communication systems often rely on modular designs in which each component, such as channel estimation, equalization, and decoding, is typically optimized separately. However, this approach tends to lead to suboptimal overall performance in the communication system due to lack of joint optimization across the entire communication chain.

[0005] As a result, the concept of a neural receiver was developed. The neural receiver includes components such as channel estimation, equalization, and channel coding, with these components treated as black boxes for joint training and optimization. In some extreme situations, which evolved into the concept of native-artificial intelligence (native-AI) communication. Native-AI communication involves integrating artificial intelligence / machine learning (AI / ML) techniques into the core structure of an AI / ML-assisted wireless communication structure. It involves E2E communication that treats the entire communication chain as a network similar to an autoencoder (AE) , aiming to jointly optimize the overall performance of a communication system including a transmitter and a receiver. On the transmitter side, an input to the transmitter includes information bits for transmission. On the receiver side, the receiver simply needs to feed received bits into a decoder network to obtain decoded an output. A data-driven communication is implemented with such transmitter and receiver.

[0006] In existing approaches, to train a neural receiver, usually a received signal (y) , pilot signal (xpilot) and a signal-to-noise ratio (SNR) value are directly regarded as the input of the neural receiver. However, if the SNR information is added only at the input of the neural receiver, the dimensionality of the SNR tends to be too small, which tends to cause SNR to be dominated by parameters of larger dimensions (e.g., y) , thus diluting its influence and causing the neural network to be unable to effectively learn the SNR information.

[0024] Implementations in accordance with the present disclosure relate to various techniques, methods, schemes and / or solutions pertaining to methods of training an E2E structure of a wireless communication system. According to the present disclosure, a number of possible solutions may be implemented separately or jointly. That is, although these possible solutions may be described below separately, two or more of these possible solutions may be implemented in one combination or another.

[0025] FIG. 1 illustrates an example scenario 100 under a proposed scheme in accordance with the present disclosure. Referring to part (A) of FIG. 1, under the proposed scheme, an AI / ML-assisted end-to-end communication system may treat an entire communication chain as a network similar to an autoencoder that includes an AI-based encoder and a corresponding AI-based decoder, so as to jointly optimize overall performance of the communication system including the transmitter side and the receiver side. On the transmitter side, an input of information bits is provided to the AI-based encoder for transmission via a pass-through channel. On the receiver side, the AI-based decoder takes bits received from the pass-through channel to decode and obtain a decoded output. Thus, the autoencoder may achieve a data-driven communication chain. Referring to part (B) of FIG. 1, under the proposed scheme, a neural receiver may be implemented on the receiver side. The neural receiver may include components such as channel estimation, equalization, and channel coding, with these components treated as black boxes for joint training and optimization.

[0026] Referring to part (C) of FIG. 1, as alluded to above, under existing approaches, values of the received signal (y) , pilot signal (xpilot) and one or more parameters (e.g., SNR) are directly provided as input to the neural receiver. In the case of the one or more parameters being or including SNR, as the value of the SNR is provided only at the input of the neural receiver, the effect of SNR is diluted as the training progresses from one deep neural network (DNN) to the next of m stages of DNN (e.g., from DNN 1 to DNN 2, from DNN 2 to DNN 3, and so on, till DNN m) . That is, DNNs further down the training pipeline do not get to learn the SNR information, thereby causing diminished effect or influence of SNR on the training results. It is noteworthy that, although examples in the present disclosure may be provided in the context of SNR, the various proposed schemes in accordance with the present disclosure may also be applicable in the context of other parameters such as, for example, an aspect of mobility (e.g., motion and / or speed) of a user equipment (UE) , a delay spread, or any other indicator. In other words, the scope of the proposed schemes is not limited to applications in which SNR is the parameter of concern (e.g., as a crucial indicator of channel conditions of the wireless communication) but, rather, may be implemented in other scenarios in which one or more other parameters (e.g., an aspect of mobility and / or a delay spread) may be the parameter (s) of concern (e.g., as one or more other crucial indicators of channel conditions.

[0027] Referring to part (D) of FIG. 1, under the proposed scheme, the value of SNR (or one or more other parameters) may be provided to a number of specific layers of the neural receiver. Accordingly, the SNR information (or the information of the one or more other parameters) may be preserved throughout the various stages of DNNs to obtain better training results. Advantageously, this design may improve the training efficiency and training results, since the SNR (or the one or more other parameters) may serve as a crucial indicator of channel conditions of the wireless communication.

[0028] FIG. 2 illustrates an example scenario 200 under a proposed scheme in accordance with the present disclosure. Scenario 200 may pertain to a comparison of a traditional communication system and an AI / MI-assisted communication structure with a neural receiver under the proposed scheme. On the transmitter side, the traditional communication system for wireless communications may include certain functional blocks, such as binary data source, channel coding, quadrature amplitude modulation (QAM) mapping, and orthogonal frequency-division multiplexing (OFDM) resource grid mapping. On the receiver side, the traditional communication system for wireless communications may include certain functional blocks, such as channel estimation, equalization, QAM demapping, and channel decoding. In the AI / ML-assisted communication structure under the proposed scheme, the functional blocks of channel estimation, equalization, and QAM demapping on the receiver side may be replaced by a trainable block of a neural receiver with SNR adaptation.

[0030] FIG. 3 illustrates an example scenario 300 under a proposed scheme in accordance with the present disclosure. Scenario 300 may pertain to a comparison of a traditional communication system and an AI / MI-assisted E2E architecture (pilotless) with a neural receiver under the proposed scheme. On the transmitter side, the traditional communication system for wireless communications may include certain functional blocks, such as binary data source, channel coding, QAM mapping, and OFDM resource grid mapping. On the receiver side, the traditional communication system for wireless communications may include certain functional blocks, such as channel estimation, equalization, QAM demapping, and channel decoding. In the AI / ML-assisted communication structure under the proposed scheme, the functional block of QAM mapping may be replaced by a mapper with a trainable constellation. Moreover, the functional blocks of channel estimation, equalization, and QAM demapping on the receiver side may be replaced by a trainable block of a neural receiver with attention-based SNR adaptation and an SNR estimator. The SNR estimator may estimate a value of SNR and then provide the estimated value of SNR to the neural receiver.

[0032] Under a proposed scheme in accordance with the present disclosure, with respect to a trainable constellation, after channel coding at the transmitter side, the transmitted data may be modulated using a learned or constellation instead of being dependent on a predefined constellation (e.g., QAM mapping) . By learning the constellation, the communication link may achieve pilotless transmission (e.g., using no pilot symbols) , since the receiver side may identify distorted symbols and bits by using the known shape of the learned constellation. The objection is to learn the vectors and which represent the real portion and imaginative portion of the complex-valued constellation point c=cRe+jcIm, respectively. The initial value may be of a QAM type. In the above expressions,  may denote the number of constellation points, and Qm may denote the number of bits per symbol. After normalizing and centering, the final constellation point may be represented as follows:  with ci denoting the element of c. Accordingly, data for transmission on the transmitter side may be modulated using the learned constellation of which may provide the optimal waveform for the receiver.

[0033] FIG. 4 illustrates an example design 400 under a proposed scheme in accordance with the present disclosure. Design 400 may pertain to an SNR estimator at the receiver side. Under the proposed scheme, as pilot information is unavailable for estimation of the SNR value in a pilotless transmission at the receiver side, a neural network-based SNR estimator may be utilized to provide an estimated SNR. The estimated SNR may then be employed to aid in training the neural receiver. Basically, the neural network may be based on a convolutional neural network (CNN) architecture with a sigmoid function as the last layer. This function may normalize and limit the SNR results to [0, 1] , resulting in less significant variations in SNR values. Consequently, the training process may exhibit greater robustness.

[0034] FIG. 5 illustrates an example design 500 under a proposed scheme in accordance with the present disclosure. Design 500 may pertain to attention features (AF) at the receiver side. Under the proposed scheme, leveraging the concept of attention in machine learning, coefficients (or weights) may be distributed to the last dimension of the original input layer (that is, filter size, related to the spatial domain) . These weights may carry SNR information (or information of any other crucial indicator of channel conditions of the wireless communication) provided by an SNR estimator (e.g., the SNR estimator of design 400) or an estimator of any other crucial indicator of channel conditions. For instance, channel coefficients (denoted as “C” in FIG. 5) containing SNR information (or information of any other crucial indicator of channel conditions) may be multiplied with the original input (denoted as “Z” in FIG. 5) . This design may effectively combine the effects of different spatial antennas on the receiver side in a way similar to the traditional maximum-ratio combining (MRC) method.

[0035] FIG. 6 illustrates an example design 600 under a proposed scheme in accordance with the present disclosure. Design 600 may pertain to a neural receiver with attention-based SNR adaptation utilizing design 400 and design 500. Referring to FIG. 6, a neural network-based SNR estimator may be utilized to provide an estimated SNR (e.g., using an SNR estimator of design 400) . The estimated SNR may then be employed to aid in training a neural receiver with attention-based SNR adaptation (e.g., as in design 500) .

[0036] It is noteworthy that the traditional communication method typically involves a least squares channel estimator (LS CE) and a linear minimum mean squared error (LMMSE) equalizer, relying on pilot symbols to estimate the channel conditions. In contrast, the autoencoder-like E2E structure under the proposed schemes may be like a data-drive communication link that does not need to transmit pilot symbols. According to the BLER (Block Error Rate) performance results in evaluation and simulation, it may be observed that the neural receiver with a learned constellation under the proposes schemes outperforms the traditional communication method by approximately 4.8dB at 10%BLER. Furthermore, the results demonstrate that the neural receiver may achieves ideal performance.

[0037] Furthermore, based on the throughput performance results in evaluation and simulation, the autoencoder-like E2E structure that does not transmit pilot symbols may increase the maximum throughput by 16%compared to the traditional communication methods of transmitting 2-symbol pilots. When compared with the operating point of the traditional communication methods (10%BLER) , it may be observed that the autoencoder-like E2E structure can enhance the throughput by 32%due to the pilotless transmission and better data recovery capabilities. Moreover, the learned constellation is no longer a typical QAM modulation in the constellation figure. Rather, the learned constellation tends to resemble a Gaussian distribution, and this shows that the autoencoder-like E2E structure has learned the concept of geometrical shaping to some extent.

[0038] In view of the above, under various proposed schemes in accordance with the present disclosure, a novel method of training an end-to-end structure of a wireless communication system may utilize a mechanism that adapts SNR (or another crucial indicator of channel conditions of a wireless communication such as, for example, an aspect of mobility and / or a delay spread) in a proposed neural receiver to retain information of the SNR (or (or the other crucial indicator (s) of channel conditions) so as to obtain better training results. The proposed neural receiver with SNR adaptation, similar to the traditional communication MRC technique, may enable better training of the neural receiver by leveraging the domain knowledge. In some implementations, the proposed neural receiver may include a neural receiver with attention-based SNR adaptation and a neural network-based SNR estimator. When paired with a trainable constellation architecture, the neural receiver with attention-based SNR adaptation and the neural network-based SNR estimator may together achieve a pilotless transmission and may further enhance spectral efficiency of the communication system. Moreover, the usage of the trainable constellation may allow for leaning a distribution similar to a Gaussian distribution. This shows that the autoencoder-like E2E communication structure can learn the concept of geometrical shaping to a certain extent. Illustrative Implementations

[0039] FIG. 7 illustrates an example communication system 700 having at least an example apparatus 710 and an example apparatus 720 in accordance with an implementation of the present disclosure. Each of apparatus 710 and apparatus 720 may perform various functions to implement schemes, techniques, processes and methods described herein pertaining to methods of training an E2E structure of a wireless communication system, including the various schemes described above with respect to various proposed designs, concepts, schemes and systems, including network environment 100, as well as processes described below.

ML-based E2E communication architecture comprises a neural receiver configured with adaptation of a parameter that serves as an indicator of channel conditions of the wireless communication.2.The method of Claim 1, wherein functions of the neural receiver comprise channel estimation, equalization, and quadrature amplitude modulation (QAM) mapping on a receiver side of the wireless communication.3.The method of Claim 2, wherein the neural receiver comprises a plurality of deep neural network (DNN) layers, and wherein information of the parameter is provided to specific DNN layers of the plurality of DNN layers in training the neural receiver.4.The method of Claim 2, wherein the neural receiver comprises a neural receiver with attention-based adaptation of the parameter, and wherein the AI /
