AI Technical Summary

Technical Problem

Existing recommendation systems struggle to accurately identify and prioritize content that matches user interests, often resulting in irrelevant or scattered recommendations.

Method used

The proposed method generates a topic description for each information set using a deep learning model, creates an information set embedding based on this description, and calculates a similarity score with a user embedding generated from historical user interactions. This similarity score determines the loading of information sets in the user interface, prioritizing relevant content.

Benefits of technology

This approach enhances the relevance and diversity of content recommendations by transforming scattered information into semantically coherent descriptions, effectively placing more relevant information sets at prominent positions in the user interface.

Abstract

The present disclosure proposes a method, apparatus and computer program product for content recommendation for a target application. A topic description corresponding to a topic associated with an information set may be generated, the information set being one of a plurality of information sets of the target application. An information set embedding of the information set may be generated based on the topic description. A set of historical items of a target user may be obtained. A user embedding of the target user may be generated based on the set of historical items. A similarity score between the information set embedding and the user embedding may be calculated. The information set may be loaded in a user interface of the target application based at least on the similarity score.

[0014] FIG. 8 illustrates another exemplary apparatus for content recommendation for a target application according to an embodiment of the present disclosure.DETAILED DESCRIPTION

[0015] The present disclosure will now be discussed with reference to several example implementations. It is to be understood that these implementations are discussed only for enabling those skilled in the art to better understand and thus implement the embodiments of the present disclosure, rather than suggesting any limitations on the scope of the present disclosure.

[0016] Content to be recommended may be associated with different topics, such as sports, finance, entertainment, weather, etc. Content with different topics can be organized into different information sets. Herein, an information set refers to a  collection of information with a predetermined topic. For example, there are sports information set, finance information set, entertainment information set, weather information set, etc. In addition, a plurality pieces of current important news may be organized into an information set with a topic of TopStories. Also, a single pieces of news may be organized into an information set with a topic of news. Preferably, such news may be personalized news for a target user. These information sets can be presented in a predefined structure in a user interface of a target application. Herein, a target application refers to an application through which recommended content is presented to users. Depending on an application to which it belongs or its structure, an information set may also be referred to as a card, a widget, a tab, etc. Users can browse these information sets to learn about information of related topics, and click on a certain information set to access richer content corresponding to the information set. The plurality of information sets may be presented in a certain layout in the user interface of the target application. It is desirable to place information sets that the target user is more interested in at a more prominent position in the user interface.

[0017] Embodiments of the present disclosure propose content recommendation based on user interest. Content to be recommended may be a plurality of information sets of a target application. Different information sets may be associated with different topics. For each information set, a topic description corresponding to a topic associated with the information set may be generated. The topic description corresponding to the topic may include a set of content categories under the topic. As an example, a topic description corresponding to a topic “finance” may be “investment advice, stock market trends, personal finance, economic indicators” . The topic description may be generated through a deep learning model, such as a large language model (LLM) . The LLM may be a deep learning model trained with a large amount of training data that can understand the meaning of natural language, generate natural language texts, or perform other natural language tasks. An information set embedding of the information set may be generated based on the topic description. A similarity score between the information set embedding and a user embedding of a target user may be calculated. The information set may then be loaded in a user interface of the target application based at least on the similarity score. In the above process, the topic of the information set is expanded as the topic description which includes a set of content categories under the topic. This approach transforms scattered information about the information set into a  semantically coherent text description and expands the semantic information of the information set, which facilitates to enable better identification of information sets that match user interests of the target user and improve the diversity of the content recommendation.

[0018] The user embedding of the target user may be generated based on a set of historical items clicked by the target user. The set of historical items may be items that the target user has clicked on in the target application or applications other than the target application. These items may be, e.g., news from news websites, product information from shopping websites, books from e-book readers, etc. A set of item embeddings corresponding to the set of historical items may be generated. For each historical item, the click number by the target user on the historical item may be obtained. The user embedding may be generated based on the set of item embeddings and a set of click numbers corresponding to the set of historical items. For example, the click number for a historical item may be considered as a weighting coefficient for an item embedding of the historical item, and the set of item embeddings may be weighted and summed to generate the user embedding. Using the historical items of the target user from various applications to generate the user embedding of the target user can mitigate the cold-start issue in content recommendation. Furthermore, the click number by the target user on an historical item can reflect the level of interest of the target user in the historical item. Considering the click number for the historical item as a weighting coefficient when generating the user embedding of the target user can facilitate the generated user embedding to more accurately indicate the points of interest of the target user.

[0019] The similarity score between the information set embedding and the user embedding of the target user may be calculated. The information set may then be loaded in the user interface of the target application based at least on the similarity score. The information set may be loaded in the user interface through several implementations. In an implementation, a comprehensive score of the information set may be calculated based on a click-through rate (CTR) score and the similarity score of the information set. A ranking of the information set among the plurality of information sets of the target application may be determined based on the comprehensive score. The information set may then be loaded in the user interface based on the ranking. In another implementation, an initial ranking of the information set among the plurality of  information sets may be determined based on the CTR score of the information set. Next, if the similarity score of the information set is greater than a score threshold, a ranking of the information set may be boosted from the initial ranking to a predetermined ranking, the predetermined ranking being higher than the initial ranking. The information set may then be loaded in the user interface based on the predetermined ranking. The similarity score between the information set embedding of the information set and the user embedding of the target user can indicate the degree of matching between the information set and user interests of the target user. The embodiments of the present disclosure propose to rank the information sets directly based on their similarity scores. The greater the similarity score of the information set is, the more likely it is to be ranked high. In this way, an information set that is more relevant to the user interests of the target user can be placed at a more prominent position in the user interface, making it easier for the target user to access.

[0020] Various embodiments of the present disclosure will hereinafter be described in connection with the appended drawings.

[0021] FIG. 1 illustrates an exemplary user interface 100 of a target application according to an embodiment of the present disclosure.

[0022] The target application has a plurality of information sets. Each information set may be associated with a predetermined topic, and have a predetermined structure. For example, in the user interface 100, a weather information set 102, a traffic information set 104, a finance information set 106, a TopStories information set 108, and news information sets 110 and 112 are illustrated.

[0023] The weather information set 102 includes weather information of a specified city. The specified city may be a city where a target user resides. The traffic information set 104 includes road condition information for a specified road. The specified road may be a road specified by the target user, or a road that the target user frequently drives on.The finance information set 106 include change trends of a stock specified by the target user. The TopStories information set 108 includes a plurality pieces of current important news. The news information sets 110 and 112 each include a piece of news, which may be personalized news for the target user.

[0024] It should be appreciated that the user interface 100 illustrated in FIG. 1 is merely an example of the user interface of the target application. Depending on actual application requirements, the target application may comprise more or fewer  information sets, and may have any other layout.

[0025] FIG. 2 illustrates an exemplary process 200 for content recommendation for a target application according to an embodiment of the present disclosure.

[0026] At 202, a topic description corresponding to a topic associated with an information set may be generated. The information set is one of a plurality of information sets of a target application. The topic description may be generated through a deep learning model, such as a LLM. The LLM may generate the topic description of the information set by using its general knowledge about the information set, logical reasoning ability and language expression ability. The topic description may include a set of content categories under the topic. An exemplary process for generating the topic description will be described later in conjunction with FIG. 3.

[0027] At 204, an information set embedding of the information set may be generated based on the topic description. The information set embedding may be generated through a LLM. For example, a prompt may be created through aggregating the set of content categories under the topic. The prompt may be input into a LLM. The information set embedding may be generated based on the prompt through the LLM.

[0028] At 206, a set of historical items of a target user may be obtained. The set of historical items may be items that the target user has clicked on in the target application or applications other than the target application. These items may be, e.g., news from news websites, product information from shopping websites, books from e-book readers, etc.

[0029] At 208, a user embedding of the target user may be generated based on the set of historical items. For example, a set of item embeddings corresponding to the set of historical items may be generated through a LLM. For each historical item, the click number by the target user on the historical item may be obtained. The user embedding may be generated based on the set of item embeddings and a set of click numbers corresponding to the set of historical items. An exemplary process for generating the user embedding will be described later in conjunction with FIG. 4.

[0030] At 210, a similarity score between the information set embedding and the user embedding may be calculated. Since both the information set embedding and the user embedding are generated through the LLM, the information set embedding and the user embedding are in the same vector space. As an example, the similarity score between the information set embedding and the user embedding may be calculated  using the following equation: similarity score = user_embedding . *information set_embedding  (1)

[0031] where . *denotes an inner product operation. It should be appreciated that the above equation is merely exemplary. The similarity score between the information set embedding and the user embedding may also be calculated using other equation.

[0032] At 212, the information set may be loaded in a user interface of the target application based at least on the similarity score. The embodiments of the present disclosure propose several implementations for loading the information set. Exemplary processes for loading the information set based on the similarity score will be described later in conjunction with FIG. 5A and FIG. 5B. The information set may be loaded in the user interface in a predefined structure corresponding to the topic associated with the information set. Referring to FIG. 1, the weather information set 102 and the traffic information set 104 are presented with different structures. The structure of the weather information set 102 corresponds to the topic of weather information set 102, i.e., weather. The structure of the traffic information set 104 corresponds to the topic of the traffic information set 104, i.e., traffic.

[0033] It should be appreciated that the process 200 in FIG. 2 is merely an example of the process for content recommendation for the target application. Depending on actual application requirements, the steps in the process for content recommendation may be replaced or modified in any manner, and the process may comprise more or fewer steps. In addition, the specific order or hierarchy of the steps in the process 200 is merely exemplary, and the process for content recommendation may be performed in an order different from the described order.

[0034] FIG. 3 illustrates an exemplary process 300 for generating a topic description corresponding to a topic according to an embodiment of the present disclosure. The process 300 may correspond to the step 202 in FIG. 2.

[0035] The process 300 may be performed on an information set 302. The information set 302 may be any of a plurality of information sets of a target application. The information set 302 has an associated topic 304, e.g., sports, finance, weather, news, TopStories, etc.

[0036] A prompt template 306 corresponding to the topic 304 may be obtained. The prompt template 306 may be created manually. Preferably, topics of information sets may be divided into different categories, and different prompt templates may be created  for different categories. An example of the prompt template may be “Assuming that you are an expert in the field of ‘Widget Topic’ , please provide the most popular ‘Widget Topic’ globally and the ‘Widget Topic’ that users commonly enjoy in their daily lives. ” In this template, “Widget Topic” may be a placeholder which may be replaced with the specific topic.

[0037] Next, a prompt 312 may be created based on the topic 304 and the prompt template 306 through a prompt creation module 310. For example, the prompt 312 may be created through replacing the placeholder in the prompt template 306 with the topic 304.

[0038] Subsequently, a topic description 322 may be generated based on the prompt 312 through a LLM 320. The LLM 320 may generate the topic description 322 by using its general knowledge about the information set, logical reasoning ability and language expression ability. The topic description 322 may include a set of content categories under the topic 304. As an example, a topic description corresponding to a topic “finance” may be “investment advice, stock market trends, personal finance, economic indicators” . As another example, a topic description corresponding to a topic “traffic” may be “local transportation news, road safety tips, public transit updates” . As yet another example, a topic description corresponding to a topic “TopStories” may be “important current news, social dynamics, economic development, global perspective” .

[0039] In the process 300, the topic 304 of the information set 302 is expanded as the topic description 322 which includes a set of content categories under the topic 304. This approach transforms scattered information about the information set into a semantically coherent text description and expands the semantic information of the information set, which facilitates to enable better identification of information sets that match user interests of the target user and improve the diversity of the content recommendation.

[0040] It should be appreciated that the process 300 in FIG. 3 is merely an example of the process for generating the topic description corresponding to the topic. Depending on actual application requirements, the steps in the process for generating the topic description may be replaced or modified in any manner, and the process may comprise more or fewer steps.

[0041] FIG. 4 illustrates an exemplary process 400 for generating a user embedding of a target user according to an embodiment of the present disclosure. The process 400  may correspond to the step 208 in FIG. 2.

[0042] A set of historical items 402 may be items previously clicked by a target user in a target application or applications other than the target application. These items may be, e.g., news from news websites, product information from shopping websites, books from e-book readers, etc. The set of historical items 402 include a historical item 402-1, a historical item 402-2, …, a historical item 402-M, wherein M is the number of historical items in the set of historical items 402.

[0043] A set of item embeddings 412 corresponding to the set of historical items 402 may be generated through a LLM 410. The set of item embeddings 412 include an item embedding 412-1, an item embedding 412-2, …, an item embedding 412-M. For each historical item 402-m (1≤m≤M) in the set of historical items 402, an item embedding 412-m of the historical item 402-m may be an Ada embedding which is generated based on a title, a body, etc. of the historical item 402-m.

[0044] For each historical item 402-m in the set of historical items 402, the click number 404-m by the target user on the historical item 402-m may be obtained. The click number may be obtained from, e.g., a log for the target. A set of click numbers 404 corresponding to the set of historical items 402 may be obtained, including a click number 404-1, a click number 404-2, …, a click number 404-M.

[0045] Subsequently, a user embedding 422 may be generated based on the set of item embeddings 412 and the set of click numbers 404 through an aggregation module 420. For example, the click number 404-m for the historical item 402-m may be considered as a weighting coefficient for the item embedding 412-m of the historical item 402-m, and the set of item embeddings 412 may be weighted and summed to generate the user embedding 422. The user embedding 422 may be generated using the following equation: user_embedding = SUM (click_number m *item_embedding m)  (2)

[0046] It should be appreciated that the above equation is merely exemplary. The user embedding may also be generated through other aggregation operations.

[0047] In the process 400, the historical items of the target user from various applications are used to generate the user embedding of the target user, which can mitigate the cold-start issue in content recommendation.

[0048] It should be appreciated that the process 400 in FIG. 4 is merely an example of the process for generating the user embedding of the target user. Depending on actual application requirements, the steps in the process for generating the user embedding may be replaced or modified in any manner, and the process may comprise more or fewer steps. For example, in the process 400, the item embedding is generated through the LLM, the embodiments of the present disclosure are not limited thereto. Depending on actual application requirements, the item embedding may be generated through other models. In addition, the specific order or hierarchy of the steps in the process 400 is merely exemplary, and the process for generating the user embedding may be performed in an order different from the described order.

[0049] FIG. 5A illustrates an exemplary process 500a for loading an information set in a user interface of a target application according to an embodiment of the present disclosure. The process 500a may correspond to an implementation of the step 212 in FIG. 2.

[0050] At 502, a CTR score of an information set of a target application may be calculated through a CTR prediction model. The CTR prediction model may be a decision tree-based machine learning model, which is trained by using a set of training samples, each of which includes an information set and a label indicating whether the information set has been clicked.

[0051] At 504, a comprehensive score of the information set may be calculated based on the CTR score and a similarity score of the information set. The similarity score is a score calculated based on an information set embedding of the information set and a user embedding of a target user, as described above. For example, the comprehensive score may be calculated using the following equation: comprehensive score =α *CTR score + β *similarity score  (3)

[0052] where α and β are coefficients for the CTR score and the similarity score, respectively. It should be appreciated that the above equation is merely exemplary. The comprehensive score may also be calculated using other equation.

[0053] At 506, a ranking of the information set among a plurality of information sets of the target application may be determined based on the comprehensive score. For  example, the steps 502 and 504 may be performed for each information set in the plurality of information sets, to obtain a plurality of comprehensive scores corresponding to the plurality of information sets. Subsequently, the plurality of information sets may be ranked based on the plurality of comprehensive scores. Accordingly, the ranking of each information set may be determined.

[0054] At 508, the information set may be loaded in the user interface of the target application based on the ranking of the information set.

[0055] FIG. 5B illustrates another exemplary process 500b for loading an information set in a user interface of a target application according to an embodiment of the present disclosure. The process 500b may correspond to another implementation of the step 212 in FIG. 2.

[0056] At 552, a CTR score of an information set of a target application may be calculated through a CTR prediction model. The CTR prediction model may be a decision tree-based machine learning model, which is trained by using a set of training samples, each of which includes an information set and a label indicating whether the information set has been clicked.

[0057] At 554, an initial ranking of the information set among a plurality of information sets of the target application may be determined based on the CTR score. For example, the step 552 may be performed for each information set in the plurality of information sets, to obtain a plurality of CTR scores corresponding to the plurality of information sets. Subsequently, the plurality of information sets may be ranked based on the plurality of CTR scores. Accordingly, the initial ranking of each information set may be determined.

[0058] At 556, it may be determined whether a similarity score of the information set is greater than a score threshold. The similarity score is a score calculated based on an information set embedding of the information set and a user embedding of a target user, as described above.

[0059] If it is determined that the similarity score is greater than the score threshold, the process 500b may proceed to a step 558. At 558, a ranking of the information set may be boosted from the initial ranking to a predetermined ranking. The predetermined ranking is higher than the initial ranking. For example, based on the system design, a ranking of a weather information set may be always the first place. In this case, the predetermined ranking of the information set with the similarity score greater than the  score threshold may be boosted to the second place. At 560, the information set may be loaded in the user interface based on the predetermined ranking.

[0060] If it is determined that the similarity score is not greater than the score threshold, the process 500b may proceed to a step 562. At 562, the initial ranking of the information set may be maintained. At 564, the information set may be loaded in the user interface based on the initial ranking.

[0061] The similarity score between the information set embedding of the information set and the user embedding of the target user can indicate the degree of matching between the information set and user interests of the target user. In the process 500a and the process 500b, the information sets are ranked directly based on their similarity scores. The greater the similarity score of the information set is, the more likely it is to be ranked high. In this way, an information set that is more relevant to the user interests of the target user can be placed at a more prominent position in the user interface, making it easier for the target user to access.

[0062] It should be appreciated that the process 500a and the process 500b in FIG. 5A and FIG. 5B are merely examples of the process for loading the information set in the user interface of the target application. Depending on actual application requirements, the steps in the process for loading the information set may be replaced or modified in any manner, and the process may comprise more or fewer steps. In addition, the specific order or hierarchy of the steps in the process 500a or the process 500b is merely exemplary, and the process for loading the information set may be performed in an order different from the described order.

[0063] FIG. 6 is a flowchart of an exemplary method 600 for content recommendation for a target application according to an embodiment of the present disclosure.

[0064] At 610, a topic description corresponding to a topic associated with an information set may be generated, the information set being one of a plurality of information sets of the target application.

[0065] At 620, an information set embedding of the information set may be generated based on the topic description.

[0074] In an implementation, the loading the information set in a user interface of the target application based at least on the similarity score may comprise: calculating a CTR score of the information set through a CTR prediction model; calculating a comprehensive score of the information set based on the CTR score and the similarity score; determining a ranking of the information set among the plurality of information sets based on the comprehensive score; and loading the information set in the user interface based on the ranking.

[0075] In an implementation, the loading the information set in a user interface of the target application based at least on the similarity score may comprise: calculating a CTR score of the information set through a CTR prediction model; determining an initial ranking of the information set among the plurality of information sets based on the CTR score; determining whether the similarity score is greater than a score  threshold; in response to determining that the similarity score is greater than the score threshold, boosting a ranking of the information set from the initial ranking to a predetermined ranking, the predetermined ranking being higher than the initial ranking; and loading the information set in the user interface based on the predetermined ranking.
