Description

METHODS AND APPARATUS OF AI BASED COMPRESSED SENSING FOR BEAM PREDICTION FOR MIMO WIRELESS COMMUNICATION SYSTEMSFIELD

[0001] The present disclosure relates generally to communication systems, and more particularly, the method of AI based compressed sensing for beam prediction for MIMO wireless communication systems.BACKGROUND

[0002] In conventional network of 3rd generation partnership project (3GPP) 5G new radio (NR) , sub-6GHz and millimeter wave (mmWave) bands are widely used. The former is mainly used for the coverage of basic networks, while the latter is widely used in ultra-low delay and ultra-high bandwidth communication scenarios for its rich spectrum resources and short wavelength. However, mmWave signals are more susceptible to attenuation and absorption by obstacles such as buildings, trees, and even rain. They also have a shorter range and cannot penetrate solid objects as well as traditional wireless signals. In order to overcome the large path loss in mmWave communications, beamforming technology is introduced to enhance the signal strength and propagation ability.

[0003] In beam management, the optimal beam is selected by beam sweeping and beam measurement which can be jointly known as beam searching / training. The traditional beam searching method is exhaustive which introduces much beam training overhead. It is time-inefficient to measure the beam quality information one by one for all candidate beams in the beamforming codebook. The other hierarchical beam searching method can greatly save the training overhead by firstly searching among the wide beams and then searching the narrow beams within the angle range of the selected wide beam [1] . The beam is selected according to a metric that partly reflects the beam quality. The signal-to-noise ratio (SNR) , reference signal received power (RSRP) , and received signal strength (RSS) are often used to indicate the beam quality.

[0004] Beam prediction is a good way to achieve accurate beam selection by using the spatial and temporal correlations of RSRP measurements. The RSRP measurements of all beam pairs in the codebook (i.e. RSRP matrix) can be shown as an image. Its sparsity that is reflected in the shade of the small grid can be well used. Suppose that denotes the complete RSRP image, according to compressed sensing, we have F=Φ1XΦ2 . where denotes the compressed RSRP image,  and  are two measurement / sensing matrix. The above expression can be converted to vector form f = Φx, where f =vec (F) , x=vec (X) ,  is known as the equivalent sensing matrix in CS.Given the observed signal / compressed RSRP image and sensing matrix, the compression reconstruction algorithm can be applied to solve the following optimization problem:

[0005] min ||x||1

[0006] where the hyper-parameterε is determined by the error of the reconstruction algorithm.

[0007] In this invention, apparatus and mechanisms are sought to use AI based compressed sensing to perform beam prediction for beam management of MIMO wireless communication systems.SUMMARY

[0008] The following presents a simplified summary of one or more aspects in order to provide a basic understanding of such aspects. This summary is not an extensive overview of all contemplated aspects, and is intended to neither identify key or critical elements of all aspects nor delineate the scope of any or all aspects. Its sole purpose is to present some concepts of one or more aspects in a simplified form as a prelude to the more detailed description that is presented later.

[0010] After the training stage, UE indicates the trained network sensing matrix to network. UE and network deploy the sensing matrix separately. In the prediction stage, UE performs weighted beam measurement by deploying sensing matrices and obtains the compressed RSRP image. UE reconstructs RSRP image based on the compressed RSRP image and deployed sensing matrices. In one embodiment, the reconstruction procedure is implemented by an AI model. The optimal beam prediction is further performed based on the reconstructed RSRP image.

[0021] Figure 1 illustrates a schematic system diagram illustrating an exemplary wireless network in accordance with embodiments of the current invention. Wireless system includes one or more fixed base infrastructure units forming a network distributed over a geographical region. The base unit may also be referred to as an access point, an access terminal, a base station, a Node-B, an eNode-B, a gNB, or by other terminology used in the art. As an example, base stations serve a number of mobile stations within a serving area, for example, a cell, or within a cell sector. In some systems, one or more base stations are coupled to a controller forming an access network that is coupled to one or more core networks. gNB 1and gNB 2 are base stations in NR, the serving area of which may or may not overlap with each other. As an example, UE1 or mobile station is only in the service area of gNB 1 and connected with gNB1. UE1 is connected  with gNB1 only, gNB1 is connected with gNB 1 and 2 via Xn interface. UE2 is in the overlapping service area of gNB1 and gNB2.

[0022] Figure 1 further illustrates simplified block diagrams for UE2 and gNB2, respectively. UE has an antenna, which transmits and receives radio signals. A RF transceiver, coupled with the antenna, receives RF signals from antenna, converts them to baseband signal, and sends them to processor. In one embodiment, the RF transceiver may comprise two RF modules (not shown) . A first RF module is used for transmitting and receiving on one frequency band, and the other RF module is used for different frequency bands transmitting and receiving which is different from the first transmitting and receiving. RF transceiver also converts received baseband signals from processor, converts them to RF signals, and sends out to antenna. Processor processes the received baseband signals and invokes different functional modules to perform features in UE. Memory stores program instructions and data to control the operations of mobile station. UE also includes multiple function modules that carry out different tasks in accordance with embodiments of the current invention.

[0023] A RRC State controller, which controls UE RRC state according to network’s command and UE conditions. RRC supports the following states, RRC_IDLE, RRC_CONNECTED and RRC_INACTIVE.

[0024] A DRB controller, which controls to establish / add, reconfigure / modify and release / remove a DRB based on different sets of conditions for DRB establishment, reconfiguration and release. A protocol stack controller, which manage to add, modify or remove the protocol stack for the DRB. The protocol Stack includes SDAP, PDCP, RLC, MAC and PHY layers.

[0025] In one embodiment, the SDAP layer supports the functions of transfer of data, mapping between a QoS flow and a DRB, marking QoS flow ID, reflective QoS flow to DRB mapping for the UL SDAP data PDUs, etc.

[0026] In one embodiment, the PDCP layer supports the functions of transfer of data, maintenance of PDCP SN, header compression and decompression using the ROHC protocol, ciphering and deciphering, integrity protection and integrity verification, timer based SDU discard, routing for split bearer, duplication, re-ordering and in-order delivery; out of order delivery and duplication discarding.

[0028] In one embodiment, the MAC layer supports the following functions: mapping between logical channels and transport channels, multiplexing / demultiplexing, HARQ, radio resource selection, etc.

[0029] Similarly, gNB2 has an antenna, which transmits and receives radio signals. A RF transceiver, coupled with the antenna, receives RF signals from antenna, converts them to baseband signals, and sends them to processor. RF transceiver also converts received baseband signals from processor, converts them to RF signals, and sends out to antenna. Processor processes the received baseband signals and invokes different functional modules to perform features in gNB2. Memory stores program instructions and data to control the operations of gNB2.

[0030] Figure 2 illustrates an exemplary inter-layer structure diagram of the proposed neural network that predicts the optimal beam pair with the sensing matrix as trainable parameters in accordance with embodiments of the current invention. The RSRP matrix X, also referred to as an RSRP image, is obtained through UE measurements and comprises CT×CR elements. Each element of the matrix represents the RSRP measured by a beam pair between the network and UE. Multiplication of a sensing matrix Φ1 and Φ2 on both sides of the RSRP matrix results in a compressed RSRP image (i.e., Compressed RSRP matrix) F (F=Φ1XΦ2) , which contains M×N elements. Due to the sparsity of the original RSRP image, the compressed RSRP image can contain maximal information from the original matrix under appropriate sensing matrix configurations and can be reconstructed to original matrix by certain methods. In one embodiment, the reconstruction algorithm is used by traditional greedy algorithm such as Orthogonal Matching Pursuit (OMP) or subspace pursuit (SP) . In one embodiment, the reconstruction procedure is implemented by an AI model. In one embodiment, multiple long short-term memory (LSTM) layers are used for the AI model for reconstruction.

[0031] Figure 3 illustrates an exemplary overall flow for the training stage of AI based compress sensing for beam prediction in accordance with embodiments of the current invention. To obtain detailed channel characteristics between UE and gNB, the UE performs full beam sweeping to generate an RSRP matrix X that contains all Tx / Rx beam pairs and their corresponding RSRP. In one embodiment, UE performs the full beam sweeping several times at different time to collect sufficient samples for model training and sensing matrices parameters tuning. UE generates and optimizes the sensing matrix for network Φ1 and UE Φ2, and the compressed RSRP matrix (RSRP image) can be derived as F=Φ1XΦ2. In one embodiment, the principle for finding proper sensing matrices and AI model is to have the minimum error between the reconstructed matrix  (predicted from compressed RSRP matrix) and the original RSRP matrix X. In one embodiment, UE trains an AI model for reconstructing from compressed RSRP image F to RSRP image X. In one embodiment, UE informs the network sensing matrix Φ2 to network for deployment after training

[0032] In one embodiment, UE report the measured RSRP matrix to network and network do the training to optimize the sensing matrices Φ1 and Φ2 for network and UE. In one embodiment, UE reports multiple historical measured RSRP matrices to network to provide sufficient samples for model training and sensing matrices parameters tuning. In one embodiment, network trains an AI model for reconstructing from compressed RSRP image F to RSRP image X. In one embodiment, network indicates the UE sensing matrix Φ2 to UE for deployment after training

[0033] In one embodiment, network or UE generates and optimizes one side network sensing matrix Φ1 or UE sensing matrix Φ2, and the compressed RSRP matrix (RSRP image) can be derived as F′=Φ1X or F′=XΦ2. In one embodiment, the compressed RSRP image can be reconstructed to RSRP image by one side reconstruction by network or UE without signaling interaction between UE and network. In one embodiment, network or UE trains an AI model for reconstructing from compressed RSRP image F’ to RSRP image X.

[0034] Figure 4 illustrate an exemplary overall flow for predicting stage of AI based compress sensing for beam prediction in accordance with embodiments of the current invention. In one embodiment, the  compressed RSRP matrix (RSRP image) can be derived as F=Φ1XΦ2, UE and network deploys sensing matrix Φ2 and Φ1 after training. In one embodiment, UE do the training at training stage, and UE indicates the network sensing matrix Φ1 to the gNB for deployment, UE deploys the UE sensing matrix Φ2 . In one embodiment, UE also deploys the well-trained AI model. In one embodiment, network do the training at training stage, and network indicates the UE sensing matrix Φ2 to UE for deployment, network deploys the network sensing matrix Φ1 . In one embodiment, network also deploys the well-trained AI model.

[0035] During the predicting stage, UE performs weighted beam measurement and obtains the compressed RSRP image F. In one embodiment, the weighted beam measurement is performed as a kind of digital precoding for beamforming by deploying sensing matrices. In one embodiment, network transmits beamformed signals by controlling the weights of the power of different beams based on sensing matrix Φ1. In one embodiment, UE receives multiple beams by digital precoding for beamforming to perform weighted beam measurement, the digital precoding for beamforming is controlled by the sensing matrix Φ2. In one embodiment, UE performs weighted beam measurement multiple times to collect enough samples for predicting compressed RSRP image in the future.

[0037] Figure 6 illustrate an exemplary overall flow to perform optimal beams prediction on spatial and time domain by predicting and reconstructing compressed RSRP image in accordance with embodiments of the current invention. In one embodiment, UE predicts the future compressed RSRP image FN based on historical measured compressed RSRP images (e.g., F1, F2, F3…) . In one embodiment, the prediction is implemented by an AI model. UE reconstructs the predicted compressed RSRP image FN to a predicted RSRP image based on the configured sensing matrices. In one embodiment, UE predicts and reconstructs the future RSRP image directly based on historical measured compressed RSRP images (e.g., F1, F2, F3…) . In one embodiment, the prediction and reconstruction are implemented by an AI model.
