Abstract

Example embodiments of the present disclosure relate to a solution for improving artificial intelligence (AI) or machine learning (ML) positioning. In an aspect, a terminal device transmits, to a network device, a request for a neural network module cascaded after a pre-trained model. The terminal device receives, from the network device, a trained neural network module cascaded after the pre-trained model and an order of a set of input signals from a set of transmission and reception points (TRPs) to be input to the terminal device. The terminal device performs, based on the trained neural network module cascaded after the pre-trained model, an AI / ML positioning by using the set of input signals from the set of TRPs in the order. In this way, the trade-off among model performance, model complexity and computational complexity can be achieved.

[0045] In view of the above, some embodiments of the present disclosure proposed a solution for improving AI / ML positioning, for example, balancing the positioning accuracy and model training and storage consumption. In some example embodiments of the present disclosure, the network device trains a NN module based on the pre-trained model and according to the number and combination TRPs selected by the terminal device for direct AI / ML positioning. Therefore, the trained NN module is specific to a specific TRP pattern (both number and combination) indicated by the terminal device and the terminal device may perform AI / ML positioning based on the downloaded or received trained NN module cascaded after the pre-trained model. That is to say, for a specific TPR pattern indicated the terminal device, the network device trains only one light weighted customized NN model, and even the specific TRP pattern has a small number of selected TRPs, the AI / ML positioning accuracy will meet the accuracy requirement, thereby achieving trade-off among model performance, model complexity and computational complexity.

[0046] For illustrative purposes, principle and example embodiments of the present disclosure for the ML framework for enhanced localization will be described below with reference to Figs. 1-9. However, it should be noted that these embodiments are given to enable the skilled in the art to understand inventive concepts of the present disclosure and implement the solution as proposed herein, and not intended to limit scope of the present disclosure in any way.

[0047] Fig. 1 illustrates an example network environment 100 in which example embodiments of the present disclosure may be implemented. The environment 100, which may be a part of a communication network, includes terminal devices and network devices. As illustrated in Fig. 1, the communication network 100 may include a terminal device 110 (hereinafter may also be referred to as a user equipment 110 or a UE 110) . The communication network 100 may further include a network device 120, a network device 130 (hereinafter may also be referred to as a transmitter / receiver point (TRP) or site) and a network device 140 (hereinafter may also be referred to as an access network device comprising a location management function entity (LMF) ) . In DL positioning, the network device or TRP 120 and 130 may transmit positioning reference signals (PRS) to the terminal device 110, and the network device 140 may request the UE 110 to collect PRS samples for each selected TRP 120 or 130.

[0048] It is to be understood that the number of network devices and terminal devices is given only for the purpose of illustration without suggesting any limitations. The system 100 may include any suitable number of network devices and / or terminal devices adapted for implementing embodiments of the present disclosure. Although not shown, it would be appreciated that one or more terminal devices may be located in the environment 100.

[0049] Communications in the network environment 100 may be implemented according to any proper communication protocol (s) , comprising, but not limited to, the third generation (3G) , the fourth generation (4G) , the fifth generation (5G) or beyond, wireless local network communication protocols such as institute for electrical and electronics engineers (IEEE) 802.11 and the like, and / or any other protocols currently known or to be developed in the future. Moreover, the communication may utilize any proper wireless communication technology, comprising but not limited to: multiple-input multiple-output (MIMO) , orthogonal frequency division multiplexing (OFDM) , time division multiplexing (TDM) , frequency division multiplexing (FDM) , code division multiplexing (CDM) , Bluetooth, ZigBee, and machine type communication (MTC) , enhanced mobile broadband (eMBB) , massive machine type communication (mMTC) , ultra-reliable low latency communication (URLLC) , carrier aggregation (CA) , dual connection (DC) , and new radio unlicensed (NR-U) technologies.

[0050] It is to be understood that the number of devices and their connection relationships and types shown in Fig. 1 are for illustrative purposes only without suggesting any limitation. The communication system 100 may include any suitable number of devices adapted for implementing embodiments of the present disclosure.

[0051] In the 3GPP RAN1 #112 discussion, it has agreed to consider CIR / PDP as candidate model inputs for AI / ML positioning. It has agreed to study the specification impact on the new model input, with respect to the trade-off among model performance, model complexity and computational complexity. In the latest 3GPP RAN1 #112-e meeting, it has agreed to evaluate the performance, overhead, and complexity for model input size of different approaches. For the evaluation of AI / ML based positioning, the study of model input due to different number of TRPs include the following approaches. Proponent of each approach provides analysis for model performance, signaling overhead (including training data collection and model inference) , model complexity and computational complexity.

[0052] For Approach 1 in which the model input size stays constant as NTRP=18, the  number of TRPs (N’ TRP) that provide measurements to model input varies. When N’ TRP < NTRP, the remaining (NTRP -N’ TRP) TRPs do not provide measurements to model input, i.e., measurement value is set to 0. As for Approach 1-A: the set of TRPs (N’ TRP) that provide measurements is fixed. As for Approach 1-B: the set of TRPs (N’ TRP) that provide measurements can change dynamically. It may be noted: for Approach 1, one model is provided to cover the entire evaluation area.

[0053] For Approach 2 in which the TRP dimension of model input is equal to the number of TRPs (N’ TRP) that provide measurements as model input, when N’ TRP < NTRP, the remaining (NTRP -N’ TRP) TRPs are ignored by the given model. For a given AI / ML model, the set of TRPs (N’ TRP) that provide measurements is fixed. As to Approach 2-A: one model can be provided to cover the entire evaluation area, which is equivalent to deploying N’ TRP TRPs in the evaluation area for positioning if ignoring the potential inference from the remaining (18 -N’ TRP) TRPs. As for Approach 2-B, if Nmodel (Nmodel >1) models are provided to cover the entire evaluation area, the total complexity (model complexity is the summation of the Nmodel models.

[0054] The inventors of the present disclosure have evaluated the two above approaches, i.e. Approach 1 and Approach 2. For Approach 1, in the evaluation, the model input parameter size is fixed to NTRPs = 18 for all cases. When a subset of 18 TRPs is considered, the remaining of non-selected TRPs are set to zero. The localization accuracy and model complexity are given in the following Table 1. However, as shown in Table 1, when the TRP number of input CIR / PDP signals is small (e.g., 4 TRPs, 8 TRPs, 12 TRPs) , the positioning accuracy is very poor.

[0055] Table 1-For Approach 1 -Evaluation for different number of TRPs (N_TRPs) considering an arbitrarily TRPs selection and compared with their respective model complexity and computational complexity. The input parameter is PDP, the N’ t =128, and UE distribution area = 120 x 60 m.

[0056] As shown in table 1, when the TRP number of input CIR / PDP signals is small (e.g., 4 TRPs, 8 TRPs, 12 TRPs) , the positioning accuracy is quite low. For example, when 4 TRPs are used, the horizontal 2D error at CDF 90% (measured in meter) is about 57.7m; when 8 TRPs are used, the horizontal 2D error at CDF 90% (measured in meter) is about 32.84 m; and when12 TRPs are used, the horizontal 2D error at CDF 90% (measured in meter) is about 21.06 m. It is obvious that the positioning accuracy is not in conformity with the required accuracy such as about 1 meter.

[0057] For Approach-2, in the evaluation, many specific models for specific TRP patterns having N TRPs have been trained by the inventors. As shown in Table 2, the positioning accuracy is much higher than Approach 1 in the small TRP number cases. However, to accommodate different TRP patterns in real world implementation,  models should be trained and stored, wherein N is the number of TRPs for the TRP pattern, which would cause tremendous waste of computation power and memory storage.

[0058] Table 2 –For approach 2 -Evaluation for different number of TRPs (N_TRPs) considering an arbitrarily TRPs selection and compared with their respective model complexity and computational complexity. The input parameter is PDP, the N’ t =128, and UE distribution area = 120x60 m.

[0059] As shown in Table 2, when the TRP number of input CIR / PDP signals is e.g., 4 TRPs, 8 TRPs, 12 TRPs, the positioning accuracies are about 2.3317m, 2.5684m, and 1.3404m, respectively. However, as mentioned above, for each specific TRP pattern  having N TRPs,  models should be trained and stored, and it would cause tremendous waste of computation resource and memory storage.

[0060] Based on the above observations, referring to above evaluation of Approach 1, when deploying the universal-TRP-pattern model at UE, positioning accuracy could be very poor when only a small subset of TRPs are connected to UE. Referring to above evaluation of Approach 2, when deploying the specific-TRP-pattern model at UE, acceptable positioning accuracy can be achieved while the model is only suitable for a specific TRP pattern (the number and combination of TRPs) ; however, when the TRP pattern (either the number or combination of TRPs) changes, new specific-TRP-pattern models need to be trained and stored, which would consume large amount of computation power and storage memory.

[0061] In order to balance positioning accuracy and resource consumption (computation power and memory storage, such as model training computation resource and storage consumption) , some embodiments of the present disclosure propose a solution for improving artificial intelligence (AI) or machine learning (ML) positioning, especially, for deploying a TRP-dependent light weighted NN module based on the pre-trained TRP-Agnostic Universal Base model (TAB model) for direct AI / ML positioning.

[0062] Hereinafter, an example signal process 200 for performing AI / ML positioning will be described with reference to Fig. 2. For the purpose of discussion, the process 200 may be described with reference to Fig. 1. The process 200 may involve the terminal device 110, and the network devices 140 as illustrated in Fig. 1. It would be appreciated that although the process 200 has been described in the communication environment 100 of Fig. 1, this process may be likewise applied to other communication scenarios with similar issues.

[0063] As shown in Fig. 2, in process 200, the terminal device 110 transmits (205) a request for a neural network (NN) module cascaded after a pre-trained model to the network device 140. The network device 140 receives (210) this request. The network device 140 may be a location management function entity (LMF) . As for the pre-trained model, it will be described in details hereinafter with reference to Fig. 4. In some embodiments, the pre-trained model is a pre-trained TRP-Agnostic Universal Base model (TAB model) for direct AI / ML positioning. The terminal device 110 maintains the pre-trained TAB model, and this TAB model may be pre-trained by the network device 140,  for example, a LMF. Before transmitting the request, the terminal device 110 may inquire the network device 140 whether it also maintains the same TAB model. If the network device 140 maintains this TAB models, the network device 140 would send a confirmation message to the terminal device 110, and then the terminal device 110 transmits the request to the network device 140.

[0064] As shown in Fig. 2, in process 200, the network device 140 trains (215) the NN module based on data from a set of transmission and reception points (TRPs) selected by the terminal device 110. The set of TRPs, for example, TRPs 120 and 130, are selected by the terminal device 110, and the terminal device 110 may transmit the indices of the selected TRPs to the network device 140, and then the network device 140 may use the data from the selected TRPs to train the NN module. In some embodiments, the trained NN module is a light weighted customized NN module cascaded after the TAB model. The training for the NN module will be described in details hereinafter with reference to Fig. 5.

[0065] As shown in Fig. 2, in process 200, the network device 140 transmits (220) the trained NN module cascaded after the pre-trained model and an order of a set of input signals from the set of TRPs to be input to the terminal device 110. The terminal device 110 receives (225) this trained NN module and the mentioned order. This order should be followed by the set of input signals from the selected set of TRPs when being input to the pre-trained model (such as TAB model) maintained at the terminal device 110. The order of the set of input signals to be input to the terminal device 110 may be the same as the order of data from the set of TRPs to be used by the network device 140 for training the NN module. That is to say, when training the NN module at the network device 140, the data from the set of TRPs are input into the model in a specific order, and when the set of input signals are to be input to the terminal device 110, they may be input in this specific order.

[0066] As shown in Fig. 2 in process 200, the terminal device 110 performs (230) an artificial intelligence (AI)  / machine learning (ML) positioning based the trained NN module cascaded after the pre-trained model by using the set of input signals from the set of TRPs in the order. In some embodiments, the input signal from the set of TRP may comprise a channel impulse response (CIR) signal or a power delay profile (PDP) signal, and each of the input signals may have an index of the respective TRP.

[0067] In the process 200 of the present disclosure, based on the pre-trained model (such as, a TAB model) , the network device 140 trains a light weighted NN module according to  the number and combination TRPs selected by the terminal device 110 for direct AI / ML positioning. That is to say, the trained NN module is specific to a specific TRP pattern (number and combination of TRPs) indicated by the terminal device 110. Then, the terminal device 100 downloads and deploys this trained NN module at the output of the pre-trained model, that is to say, the downloaded trained NN module is cascaded after a pre-trained model. Then, the terminal device 100 may perform AI / ML positioning based on the trained NN module cascaded after the pre-trained model. That is to say, for a specific TPR pattern having N selected TRPs indicated the terminal device, the network device trains and stores only one light weighted customized NN model for this specific TPR pattern, rather than according to above mentioned Approach 2, thereby significantly reducing the training complexity, computation power and storage memory. Further, for each TRP pattern, when the direct AI / ML positioning is performed, the trained NN module is cascaded after a pre-trained universal model, the trained NN module and the pre-trained universal model will both contribute to the computation of the positioning coordinate, and thus even the specific TRP pattern has a few selected TRPs, the AI / ML positioning accuracy will meet the accuracy requirement and will be higher than that obtained by above mentioned Approach 1.

[0068] Hereinafter, an example signaling process for deploying a customized neural network (NN) module cascaded after the frozen TAB model for direct AI / ML positioning at a terminal device side in accordance with some embodiments of the present disclosure will be descried with reference to Fig. 3.

[0069] As shown in Fig. 3, at Step-0, the UE 110 should maintain a TAB model, which is the pre-condition of this framework. For example, a network device, for example, a LMF 140 may pre-train this TAB model. At Step-1, the UE 110 queries if LMF 140 maintains the same TAB model, for example, via a message. If the LMF 140 does not maintain the same TAB model, the procedures would be terminated.

[0070] If the LMF 140 maintains the same TAB model, the procedures would continue. The LMF 140 would send confirmation of maintaining the same TAB model to the UE 110 at Step-2 via a new message. When receiving a confirmation of maintaining the same TAB model from the LMF 140, at Step-3, the UE 110 sends a request to the LMF 140 for a light weighted customized NN module cascaded after the TAB model for direct AI / ML positioning via a new message. As shown in Fig. 3, at Step-4, the UE 110 indicates the  indices of its selected TRPs 120 and 130 to the LMF 140. For example, the indices of the selected TRPs are #9#15#18.

[0071] At Step-5, the LMF 140 trains the TRP-dependent light weighted neural network (NN) module cascaded after the TAB model using the data from the selected TRP subset (for example, TRPs 120 and 130) for direct AI / ML positioning. It should be noted that, in the training process, the TAB model is frozen and the parameters of the TAB model will not be tuned, and only the parameters in the light weighted customized NN module are tuned. The CIR / PDP signals from the selected TRP subset are fed into the TAB model in a configured TRP index order. For example, the configured TRP index order is #15#18#9, rather than the indices (for example, #9#15#18) of the selected TRPs indicated by the UE 110.

[0072] At Step-6, the LMF 140 sends the trained TRP-dependent light weighted NN module to the UE 110. As shown in Fig. 3, at Step-7, the LMF 140 indicates to the UE 110 the TRP index order (for example, #15#18#9) of the input signals to be used by the UE 110 when feeding signals into the TRP-dependent light weighted NN module cascaded after TAB model at the UE 110 for direct AI / ML positioning. For example, if the indices of the selected TRPs are #9#15#18, the TRP index order of input signals is configured by the LMF 140 as #15#18#9, then the signals should be input by the UE 110 into the model in an order of #15#18#9, rather than #9#15#18 or other index orders.

[0073] At Step-8, the LMF 140 indicates the selected TRP indices (for example, #9#15#18) to the selected TRPs. As shown in Fig. 3, at Step-9, the selected TRPs send CIR / PDP signals with their TRP indices to the UE 110. At Step-10, AI / ML positioning is conducted by the UE 110 using the TAB model cascading TRP-dependent light weighted NN module with received CIR / PDP signals from selected TRPs in the indicated input order, for example, an order of #15#18#9. It should be noted that the number of TRPs 120 and 130 is not limited to two TRPs, and the TRPs 120 and 130 are just illustrated for the purpose of explanation.

[0074] Accordingly, in some embodiments of the present disclosure, a solution for deploying a TRP-dependent light weighted NN module based on the pre-trained TRP-Agnostic Universal Base model (TAB model) for direct AI / ML positioning at UE side is proposed. In this solution, a NW (for example, a LMF 140) pre-trains a TAB model beforehand and then trains a TRP-dependent light weighted NN module as per a request  from a UE in dynamic-TRP oriented scenarios. The UE 110 also maintains the same pre-trained TAB model as precondition then requests and downloads from the LMF 140 a TAB-compatible and light weighted customized NN module that can be cascaded right after the TAB model. Since TAB model is a universal TRP-agnostic pre-trained model, when the UE 110 receives CIR / PDP signals from any TRP pattern (the TRP number is denoted as M) , the signals would be passed through the TAB model to generate M intermediate outputs. Then, the M intermediate outputs are fed to the cascaded customized NN module to generate a positioning result, for example, a two-dimension positioning coordinate. Herein, by merging the M intermediate features from specific TRP pattern, the cascaded customized NN module learns TRP-dependent positioning.

[0075] In order to evaluate the positioning accuracy of the light weighted customized NN module cascaded right after the TAB model, the inventors of the present disclosure have evaluated two following schemes with the dataset from the TRPs #9, #15, and #18 for direct AI / ML positioning, it should be noted that the dataset from the TRPs #9, #15, and #18 has not been included in the training dataset and is only for testing the prediction accuracy of the trained model.

[0076] In the first scheme, the evaluation is conducted based on the proposed TAB model and the light weighted customized NN module cascaded after the TAB model in accordance with some embodiments of the present disclosure. In the second scheme, the evaluation is conducted based on a baseline ViT, which is a specific-TRP-pattern model trained in accordance with the above mentioned legacy Approach 2, in which 196646 data samples are used for training, and the remaining data samples are used for testing.

[0077] In the following Table 3, the trainable parameters and positioning accuracy at CDF90 between the first scheme and the second scheme are compared. As shown in Table 3, compared to baseline ViT scheme in accordance with legacy Approach 2, the proposed scheme in accordance with some embodiments of the present disclosure can achieve a positioning accuracy of 1.40m at CDF90 while reducing 99.86%training complexity, that is, the trainable parameters are reduced from 42M in the second scheme to about 60K in the first scheme.

[0078] Table 3. Performance comparison of direct positioning task

[0079] As can be seen from the comparison as shown in Table 3, the positioning accuracy of 1.40m is approximate to the accuracy of 0.826m obtained by the legacy approach, that is to say, the model performance is qualified whereas the model training and computation complexity is significantly reduced by 99.86%.

[0080] In some embodiments of the present disclosure, based on the pre-trained TAB model, the NW 140 trains a light weighted customized NN module according to the number and combination of TRPs connecting with UE for direct AI / ML positioning, so as to facilitate such TAB-model-based TRP-dependent NN-module customization. In this procedure of the present disclosure, the UE 110 aligns with the LMF 140 and ensures both ends possess the same TAB model. If it is verified that the UE 110 and the LMF 140 share an identical TAB model, the UE 110 sends a request to the LMF 140 for a light weighted customized NN module cascaded after TAB model and specifically based on a selected TRP pattern for direct AI / ML positioning. Then, the LMF 140 uses the data from the selected TRP subset to train the light weighted customized NN module cascaded after the frozen TAB model for direct AI / ML positioning. The LMF 140 sends the trained light weighted customized NN module to the UE 110 and indicates the TRP index order of the input signals for model inference. The UE 110 then downloads and deploys the trained light weighted customized NN module at the output of TAB model for TRP-dependent AI / ML-direct-positioning. Then, the UE 110 inputs the CIR / PDP signals from selected TRPs to the TAB model cascading the customized NN module in the indicated input order for direct AI / ML positioning. Therefore, for a specific TRP patterns having N selected TRPs, only one light weighted customized NN module, rather models, is trained and stored, and the TAB model and the trained light weight NN module cascaded after the TAB model can both contribute to obtain a positioning result of a high accuracy.

[0081] Hereinafter, the example implementation for training the universal model (such as the TAB model) in accordance with some embodiments of the present disclosure will be described with reference to Fig. 4.

[0082] As shown in Fig. 4, the TAB model is an image-text cross-modal pre-trained model, which is consisted of two key feature extractors / encoders. The first key feature  extractor or encoder is related to an environment semantic embedding block <Text encoder>: the descriptions of physical environment (e.g., NLOS / NLOS classification, BS (TRP) location, UE location, environment classification, etc. ) are input in the form of natural language text. The second key feature extractor or encoder is related to a wireless channel feature extraction block <Image encoder>: wireless channel features (e.g., CSI, CIR, PDP, etc. ) are input in the form of image.

[0083] By maximizing the similarity between output matrixes from different models, the text encoder and image encoder are trained jointly to align the multi-modal information in a shared embedding space, allowing cross-modal semantic understanding and matching. Consequentially, the text-image cross-modal base-model learns the intrinsic wireless environment knowledge and becomes a universal model agnostic to TRP patterns.

[0084] It should be noted that the text encode will be used when training this TAB model, whereas the text encode will not be used when training the light weighted NN module and when performing the AI / ML positioning. That is to say, when training the light weighted NN module, the data from the selected TRPs may be input into the image encoder of the TAB model to generate respective intermediate outputs, and the intermediate outputs may be input into the NN module to generate a 2D positioning coordinate. Therefore, the text encoder will not be used when training the NN module. When performing the AI / ML positioning, the similar procedure will be performed, and the text encoder will not be used.

[0085] Hereinafter, an example implementation for training light weighted customized neural network (NN) module cascaded after the frozen TAB model in accordance with some embodiments of the present disclosure will be described with reference to Fig. 5.

[0086] Since the pre-trained TAB model has learned useful representations and semantic relationships between images and text during the pre-training phase, it provides a strong initial starting point. Thus, inheriting and building upon capabilities of the pre-trained TAB models, a light weighted customized NN module is trained to align with the direct AI / ML positioning task.

[0087] As shown in Fig. 5, the light weighted customized NN module is cascaded after the image encoder of the TAB model. When training the cascaded NN module, the image encoder is frozen such that the parameters of this image encoder of the pre-trained TAB model will not be tuned, and only the parameter of the light weighted customized NN module will be tuned. The light weighted customized NN module is trained using the data  from the selected TRPs, such as, TRP#1#2#3 with a specific input order, such as, TRP#2#3#1. This means that the input of the image encoder is a sample group composed of multiple CSI samples from the selected TRPs in the specific order, e.g., TRP#2#3#1. By inputting CSI sample groups with specific input order into the image encoder, the output vectors from the same sample group are concatenated with the same specific order and used as one input for the lightweight customized NN module to obtain the corresponding positioning coordinates.

[0088] In one example, the number of selected TRPs is 3, and the internal architecture of the light weighted customized NN module is given in Table 4.

[0089] Table 4 The internal architecture of the light weighted customized NN module

[0090] As shown in Table 4, the dimension of the input size N1 is 384, and the dimension of the final output size is a two-dimension positioning coordinate. Therefore, the light weighted customized NN module can be used to predict a positioning result, for example, a two-dimension positioning coordinate.

[0091] Fig. 6 illustrates a flowchart of an example method 600 implemented at a terminal device in accordance with some other embodiments of the present disclosure. For the purpose of discussion, the method 600 will be described from the perspective of the terminal device 110 with reference to Fig. 1.

[0092] At block 610, the terminal device 110 transmits a request for a neural network module cascaded after a pre-trained model to a network device 140. At block 620, the terminal device 100 receives a trained neural network module cascaded after the pre-trained model and an order of a set of input signals from a set of transmission and reception points (TRPs) to be input to the terminal device from the network device 140. At block 630, the terminal device 100 performs an artificial intelligence (AI)  / machine learning (ML) positioning by using the set of input signals from the set of TRPs in the order based on the trained neural network module cascaded after the pre-trained model.

[0093] In some embodiments, the terminal device 110 further maintains the pre-trained model; and determines whether the network device maintains the same pre-trained model. In some embodiments, the pre-trained model is a TRP-agnostic universal base (TAB) model and comprises an image encoder; and the trained neural network module is a trained light weighted neural network module specific to a TRP pattern and cascaded after the image encoder.

[0094] In some embodiments, the terminal device 110 further transmits, to the network device 140, indices of the set of TRPs selected by the terminal device, wherein the neural network module is trained by the network device 140 based on data from the set of TRPs. In some embodiments, the terminal device 110 further receives, from the set of TRPs, the set of input signals each having an index of the respective TRP.

[0095] In some embodiments, the terminal device 110 performs the AI / ML positioning by: passing the set of input signals from the set of TRPs through the pre-trained model in the order, to generate a set of intermediate outputs; and generating a positioning result by inputting the set of intermediate outputs to the trained neural network module.

[0096] In some embodiments, the input signal comprises at least one of a channel impulse response (CIR) signal or a power delay profile (PDP) signal. In some embodiments, the order of the set of input signals is the same as an order of the data from the set of TRPs for training the neural network module. In some embodiments, the network device comprises a location management function entity.

[0097] Fig. 7 illustrates a flowchart of an example method 700 implemented at a network device in accordance with some other embodiments of the present disclosure. For the purpose of discussion, the method 700 will be described from the perspective of the network device 140 with reference to Fig. 1.

[0098] At block 710, the network device 140 receives, from a terminal device 110, a request for a neural network module cascaded after a pre-trained model. At block 720, the network device 140 trains the neural network module based on data from a set of transmission and reception points (TRPs) selected by the terminal device. At block 730, the network device 140 transmits, to the terminal device 110, a trained neural network module cascaded after the pre-trained model and an order of a set of input signals from the set of TRPs to be input to the pre-trained model cascaded with the trained neural network module at the terminal device.

[0099] In some embodiments, the network device 140 further receives a signal for querying whether the network device maintains the pre-trained model from the terminal device 110, and transmits a result of the querying to the terminal device 110.

[0100] In some embodiments, the pre-trained model is a TRP-agnostic universal base (TAB) model and comprises an image encoder; and the trained neural network module is a trained light weighted neural network module specific to a TRP pattern and cascaded after the image encoder. In some embodiments, the pre-trained model further comprises a text encoder.

[0101] In some embodiments, the network device 140 further receives, from the terminal device 110, indices of the set of TRPs. In some embodiments, the network device 140 trains the neural network module by: passing data from the set of TRPs through the image encoder in the order, to generate a set of intermediate outputs; generating a positioning result by inputting the set of intermediate outputs to the neural network module; and tuning, based on the generated positioning result, at least one parameter of the neural network module to obtain the trained neural network module. In some embodiments, the network device 140 comprises a location management function entity.

[0102] In some embodiments, an apparatus (for example, the terminal device 110) capable of performing the method 600 may comprise means for performing the respective steps of the method 600. The means may be implemented in any suitable form. For example, the means may be implemented in a circuitry or software module.

[0103] In some embodiments, the apparatus comprises: means for transmitting a request for a neural network module cascaded after a pre-trained model to a network device; means for receiving a trained neural network module cascaded after the pre-trained model and an order of a set of input signals from a set of transmission and reception points (TRPs) to be input to the terminal device from the network device; and means for performing an artificial intelligence (AI)  / machine learning (ML) positioning by using the set of input signals from the set of TRPs in the order based on the trained neural network module cascaded after the pre-trained model.

[0104] In some embodiments, the apparatus further comprises means for maintaining the pre-trained model; and means for determining whether the network device maintains the same pre-trained model.

[0105] In some embodiments, the apparatus further comprises means for transmitting, to the network device, indices of the set of TRPs selected by the terminal device, wherein the neural network module is trained by the network device based on data from the set of TRPs. In some embodiments, the apparatus further comprises means for receiving, from the set of TRPs, the set of input signals each having an index of the respective TRP.

[0106] In some embodiments, the apparatus further comprises means for performing other steps in some embodiments of the method 600. In some embodiments, the means comprises at least one processor and at least one memory including computer program code, the at least one memory and computer program code configured to, with the at least one processor, cause the performance of the apparatus.

[0107] In some embodiments, an apparatus (for example, the network device 140) capable of performing the method 700 may comprise means for performing the respective steps of the method 700. The means may be implemented in any suitable form. For example, the means may be implemented in a circuitry or software module.

[0108] In some embodiments, the apparatus comprises means for receiving, from a terminal device, a request for a neural network module cascaded after a pre-trained model; means for training the neural network module based on data from a set of transmission and reception points (TRPs) selected by the terminal device; and means for transmitting, to the terminal device, a trained neural network module cascaded after the pre-trained model and an order of a set of input signals from the set of TRPs to be input to the pre-trained model cascaded with the trained neural network module at the terminal device.

[0109] In some embodiments, the apparatus further comprises: means for receiving, from the terminal device, a signal for querying whether the network device maintains the pre-trained model; and means for transmitting, to the terminal device, a result of the querying.

[0110] In some embodiments, the apparatus further comprises means for receiving, from the terminal device, indices of the set of TRPs. In some embodiments, the means for training the neural network module trains the neural network by: passing data from the set of TRPs through the image encoder in the order, to generate a set of intermediate outputs; generating a positioning result by inputting the set of intermediate outputs to the neural network module; and tuning, based on the generated positioning result, at least one parameter of the neural network module to obtain the trained neural network module.

[0111] In some embodiments, the apparatus further comprises means for performing other steps in some embodiments of the method 700. In some embodiments, the means comprises at least one processor and at least one memory including computer program code, the at least one memory and computer program code configured to, with the at least one processor, cause the performance of the apparatus.

[0112] Fig. 8 is a simplified block diagram of a device 800 that is suitable for implementing embodiments of the present disclosure. The device 800 may be provided to implement the communication device, for example the terminal device 110 and the network device 140 as shown in Fig. 1. As shown, the device 800 includes one or more processors 810, one or more memories 820 coupled to the processor 810, and one or more communication modules 840 coupled to the processor 810.
